Core Functionality

1. Environment API

reset(seed=None, task_id=None, difficulty=None) → DebugObservation

Purpose: Initialize a new episode with a debugging problem.

Parameters:

  • seed (int, optional): Random seed for reproducibility
  • task_id (str, optional): Select specific task (fix_logic_bug, fix_algorithm_bug, optimize_and_fix)
  • difficulty (str, optional): Filter by difficulty (easy, medium, hard)

Returns: DebugObservation containing:

  • problem_id (str): Unique problem identifier
  • buggy_code (str): The broken Python code
  • description (str): Human-readable problem description
  • test_cases (list): Test cases for evaluation
  • difficulty (str): Problem difficulty level
  • category (str): Error category (logic_error, type_error, etc.)
  • task_id (str): Associated task
  • task_name (str): Task description

Example:

env = PythonDebugEnvironment()
observation = env.reset(task_id="fix_logic_bug")
print(observation.buggy_code) # Get the broken code
print(observation.test_cases)      # Get test cases

step(action: DebugAction) → DebugObservation

Purpose: Process agent's code fix and compute reward.

Parameters:

  • action: DebugAction(fixed_code="<corrected Python code>")

Returns: DebugObservation with:

  • reward (float): Score in [0.0, 1.0]
  • test_score (float): Percentage of passing tests
  • quality_score (float): Code quality assessment
  • done (bool): Episode completion status

Reward Calculation:

reward = (0.7 × test_score) + (0.3 × quality_score) + improvement_bonus
clamped to [0.0, 1.0]

Example:

action = DebugAction(fixed_code="def check(x):\n    return x > 0")
observation = env.step(action)
print(f"Reward: {observation.reward:.2f}")  # e.g., 0.85
print(f"Tests: {observation.test_score:.2f}")
print(f"Quality: {observation.quality_score:.2f}")

state → DebugState

Purpose: Access current episode state.

Returns: DebugState containing:

  • current_problem (dict): Active problem
  • attempt_count (int): Number of attempts
  • rewards_history (list): Previous rewards
  • episode_reward (float): Cumulative episode reward

Example:

state = env.state
print(f"Attempt: {state.attempt_count}/3")
print(f"Episode reward: {state.episode_reward:.2f}")

2. Task Definitions

Task 1: Fix Logic Bugs

Difficulty: Easy → Medium
Problems: 10 problems
Grader: test_logic_fix(code, test_cases) → float

Typical Issues:

  • Comparison operator errors (> vs >=)
  • Off-by-one errors in loops
  • Missing edge case handling
  • Boolean logic inversions

Example Problem:

# BROKEN
def is_valid_age(age):
    return age >= 18 and age < 65  # Should be <=

# FIXED
def is_valid_age(age):
    return age >= 18 and age <= 65

Task 2: Fix Algorithm Bugs

Difficulty: Medium → Hard
Problems: 11 problems
Grader: test_algorithm_fix(code, test_cases) → float

Typical Issues:

  • Type conversion errors
  • Incorrect variable assignments
  • Loop/recursion errors
  • Wrong computation sequences

Example Problem:

# BROKEN
def find_max(numbers):
    max_val = None
    for n in numbers:
        if n > max_val:  # Error: None comparison
            max_val = n
    return max_val

# FIXED
def find_max(numbers):
    max_val = float('-inf')
    for n in numbers:
        if n > max_val:
            max_val = n
    return max_val

Task 3: Optimize & Fix

Difficulty: Hard
Problems: 9 problems
Grader: test_optimization(code, test_cases) → float

Typical Issues:

  • Complex nested logic errors
  • Performance problems
  • Recursion depth issues
  • Multiple simultaneous bugs

Example Problem:

# BROKEN
def factorial(n):
    if n == 0:
        return 1
    # Missing base case: infinite recursion on negative
    return n * factorial(n - 1)

# FIXED
def factorial(n):
    if n < 0:
        raise ValueError("n must be non-negative")
    if n == 0:
        return 1
    return n * factorial(n - 1)

3. Grading System

Test Execution (Deterministic)

Sandbox Isolation:

User Code → Subprocess Isolation → Test Execution → Results

Features:

  • Timeout protection (5 seconds per test)
  • Exception handling
  • Output capture
  • No side effects

Test Score Calculation:

test_score = passed_tests / total_tests

Example:
  3/5 tests passing → test_score = 0.6
  5/5 tests passing → test_score = 1.0

Code Quality Analysis (Static)

6 Quality Checks (via AST):

  1. Type Consistency: Variables used with correct types
  2. Variable Naming: Meaningful, consistent names
  3. Code Duplication: No unnecessary repetition
  4. Error Handling: Try-except for risky operations
  5. Performance: No obvious inefficiencies
  6. Readability: Proper indentation, comments

Quality Score Calculation:

quality_score = (checks_passed / 6) × 100%

Normalization:
  quality_score = raw_score / 100%

Result: [0.0, 1.0]

Dual Reward System

Composite Reward:

base_reward = (0.7 × test_score) + (0.3 × quality_score)

Example Calculation:

Test Score: 0.8 (4/5 tests passing)
Quality Score: 0.83 (5/6 checks passing)

base_reward = (0.7 × 0.8) + (0.3 × 0.83)
            = 0.56 + 0.249
            = 0.809

→ clamped to [0.0, 1.0] → 0.809 ✓

Improvement Bonus:

  • If base_reward > previous_reward: +0.05 bonus
  • Otherwise: no penalty

4. Problem Bank

Structure (bug_bank.py):

PROBLEMS = {
    "problem_logic_001": {
        "title": "Fix comparison operator",
        "buggy_code": "...",

    },
    ...
}

Inference Pipeline

Baseline Inference Script

File: inference.py
Purpose: Demonstrate agent performance on all 3 tasks
Usage: Run locally or on HF Space

Workflow:

1. Initialize OpenAI client (HF Router or custom endpoint)
2. For each task (fix_logic_bug, fix_algorithm_bug, optimize_and_fix):
   a. Reset environment with task_id
   b. For up to 3 attempts:
      - Get LLM response
      - Execute environment.step(action)
      - Record reward
      - Log [STEP] entry
   c. Log [END] with final score
3. Log [SUMMARY] with all task results

Logging Format (Strict Compliance):

[START] task=fix_logic_bug env=python-debug-env model=Qwen/Qwen2.5-72B-Instruct
[STEP] step=1 action="def fix(x):\n    return x > 0" reward=+0.50 done=false error=null
[STEP] step=2 action="def fix(x):\n    return x >= 0" reward=+0.75 done=false error=null
[END] success=true steps=2 score=0.75 rewards=[0.50, 0.75]
